Hybrid Machine Learning Models for Accurate Future Trend Prediction: Algorithmic Architectures, Signal Decomposition, and Empirical Benchmarking
Abstract
ABSTRACT Accurate future trend prediction across non-stationary, non-linear, and high frequency time series remains a foundational challenge in modern computational intelligence, financial engineering, renewable energy dispatch, and epidemiological forecasting. While classical econometric formulations (such as ARIMA and GARCH) exhibit mathematical rigor for linear stationary processes, they fail to capture complex non-linear dynamics and abrupt structural breaks. Conversely, standalone deep learning architectures (such as Recurrent Neural Networks, Long Short-Term Memory networks, and Transformers) and gradient-boosted decision trees (XGBoost, LightGBM) often suffer from overfitting, high sample complexity, hyperparameter sensitivity, and phase lag under chaotic noise. To transcend these individual bottlenecks, hybrid machine learning frameworks—integrating multi resolution signal decomposition techniques, spatial-temporal deep feature extractors, and meta-learning ensemble aggregators—have emerged as state of-the-art predictive paradigms. This review paper delivers a rigorous, technical, and comprehensive synthesis of hybrid machine learning architectures designed for predictive forecasting. We systematically analyze core architectural coupling mechanisms, including decomposition-coupled hybrids (VMD, CEEMDAN, Wavelet Transform), spatial-temporal hybrids (CNN-LSTM, Conv-Transformer), and heterogeneous stacking meta-learners. Through extensive empirical benchmarking across standardized industrial and financial datasets, we demonstrate that optimal decomposition-coupled hybrid configurations reduce forecast Root Mean Squared Error (RMSE) by 45% to 78% and Mean Absolute Percentage Error (MAPE) to under 3% compared to baseline standalone models. Furthermore, we dissect engineering challenges surrounding computational latency, error accumulation in multi-step auto regressive rollouts, and explainability bottlenecks, concluding with an architectural roadmap for next-generation physics-informed, transformer augmented hybrid systems.
